Use data cleaning to correct, standardize, or remove known data problems. Use data validation to check data against explicit requirements and identify whether it is fit for a particular use. Most dependable workflows need both: define what acceptable data means, clean issues using documented decisions, then validate the result and keep checking new data.
The practical distinction is straightforward: cleaning changes data; validation tests it. A failed check is evidence that a rule was not met, not an automatic instruction to change the value. The right response depends on what the data means, what the downstream use requires, and what the data owner considers acceptable.

What is the difference between data cleaning and data validation?
Data cleaning changes data; data validation checks it. Cleaning addresses problems such as inconsistent formats, duplicates, missing values, and malformed records. Validation tests whether records meet defined expectations, such as required fields, permitted types, ranges, or relationships.

A tool can flag two different date formats or an out-of-range value, but the correct standard or replacement depends on the data’s intended meaning. A business owner or other qualified subject-matter expert must decide what counts as correct.

Microsoft Learn treats profiling, cleansing, validating, and monitoring as distinct data-quality activities, rather than synonyms. Microsoft’s data-governance guidance also recommends standard definitions and consistent formats, names, and units. In practice, profiling helps you discover what the data looks like; cleaning applies corrective decisions; validation tests conformance to explicit rules; and monitoring checks quality over time.
Cleaning is corrective
Cleaning applies an understood rule to make data more consistent or usable. Examples include converting dates to an approved format, mapping equivalent category labels to one canonical value, removing a confirmed duplicate, or correcting a known malformed record. Some records may instead need to be quarantined or removed, depending on the use and the evidence available.
Cleaning is not the same as making every value look typical. An unusual amount, date, or category could be a genuine exception. A cleaning rule should explain why a representation is wrong and what the defensible correction is. If there is no approved basis for choosing a replacement, preserve the original value and send it for review rather than letting an automated process guess.

Validation compares data with explicit expectations. Great Expectations defines an Expectation as “a verifiable assertion about data.” A suite can group such assertions, and a Validation Definition associates a batch with the expectations used to check it. The result reports how the data compares with those expectations; it does not certify that every value is true. See the Great Expectations GX Core overview.
A validation rule can be as basic as requiring a column or as specific as checking whether two related fields make sense together. The rules are only as useful as the requirements they represent. A dataset can pass every check that has been written and still contain a defect that nobody thought to test.

Which should you use?
Choose based on the problem, not on a belief that one practice replaces the other. Use cleaning when you have an approved way to correct a known issue. Use validation when you need to test whether data meets requirements. If a check fails, investigate before changing the value.
Use cleaning when the problem is a known inconsistency and you can state the intended canonical form. For example, if a data dictionary defines a single date convention or unit, you can standardize existing representations to it. Use validation when the goal is to detect whether incoming data follows a requirement—for example, whether a required column exists or an identifier matches a documented pattern. When a rule fails, the outcome could be correction, quarantine, removal, a warning, or a stopped process; the check itself does not decide which remedy is right.
| Situation | Best fit | Example |
|---|---|---|
| A value has inconsistent representations and an approved canonical form exists | Cleaning | Standardize dates or units according to a data dictionary. |
| A field must be present or use an allowed type | Validation | Check required columns, column names, and data types. |
| A value must match a meaningful range or pattern | Validation, then remediation if it fails | Check an age range, identifier pattern, or accepted category; investigate an outlier before changing it. |
| Records must agree across fields or tables | Validation | Check that a transfer’s sent timestamp precedes its received timestamp, or that related totals agree across tables. |
| Legacy data has known errors | Both | Profile for issues, clean using documented rules, and validate before downstream use. |
| New data arrives continuously or in scheduled batches | Repeated validation, with a chosen failure policy | Warn and record metrics, drop invalid rows, or fail a flow based on risk and operational needs. |
For legacy data, a sensible sequence is to inspect and profile first, decide which irregularities are actual errors, apply approved corrections, and then verify the transformed result. For recurring data, keep the checks in the process that handles each batch. You may clean during a transformation, but still validate the output: a transformation intended to standardize data can itself introduce mistakes.
Why a passing validation check is not proof that data is correct
A dataset can have the expected columns and types and still contain values that are wrong in context. A schema check might confirm that a field is numeric, for example, without showing whether the number represents a sensible amount for the transaction. Schema validation establishes structural conformity, not semantic correctness.
Build checks around the ways downstream users rely on the data. Alongside required fields and types, that may mean checking allowed ranges, patterns, categories, uniqueness, timeliness, referential integrity, or business logic. Great Expectations distinguishes schema checks from data-integrity checks and describes expectations that can test relationships across fields or tables. See its guidance on schema validation and data integrity.

For example, a rule that checks a transfer’s sent and received timestamps can catch an impossible ordering that a type check would miss. A comparison of related totals across tables can reveal a mismatch even if both tables have valid column names and numeric fields. These checks are useful when the relationship affects how the data will be used; they are not substitutes for defining what the relationship should mean.
There is no universally correct ruleset. A value can be acceptable for one purpose and invalid for another. Decide what each downstream use requires, and involve the people who own the relevant business definitions. Validation is a test against those declared requirements, not proof of truth or a guarantee that every possible defect has been found.
A practical cleaning and validation workflow
- Define meaning and ownership. Record acceptable values, units, date conventions, required fields, and business rules in a data dictionary or equivalent. Identify who can approve those definitions. Standardized definitions and consistent formats help different users interpret fields in the same way, as outlined in Microsoft’s data-governance best practices. Also clarify the intended use: a condition that is important for one report or process may not be necessary for another.
- Profile the data before editing it. Look for missing values, unexpected formats, duplicate candidates, outliers, and broken relationships. Ask a data owner whether each finding is an error or a legitimate exception. An unusual value is a reason to investigate, not automatic permission to overwrite it. Separating discovery from correction reduces the risk of turning an unfamiliar but valid case into a bad edit.
- Clean only when the rule is understood. Standardize, correct, deduplicate, fill, quarantine, or remove records only when the intended outcome is defensible. Where auditability matters, preserve the raw data or keep a change record so that a correction can be reviewed. This is an operational practice to support review; it is not a claim that every validation platform automatically records every cleaning decision.
- Validate structure and meaning. Check required fields and types, then add the ranges, patterns, uniqueness, timeliness, relationship, and business-logic checks relevant to the intended use. A check that tests structure alone will not cover those other dimensions. Keep the rules explicit so that a failed result can be understood as a comparison with a known expectation rather than a vague judgment that data looks wrong.
- Decide what happens when a check fails. Choose whether the system should report a warning, retain the record while capturing metrics, quarantine or drop it, or stop the affected flow. The right choice depends on the consequences of letting bad data proceed. A low-risk anomaly may call for monitoring and investigation; a failure that would undermine a critical downstream use may justify stopping the flow.
- Run checks after transformations and on later batches. Cleaning can introduce mistakes, and new data can fail rules that yesterday’s batch passed. Recheck after meaningful transformations and repeat validation as data arrives. A repeatable validation result makes it possible to inspect how a particular batch compared with the declared rules and to follow up when failures occur.
- Review the rules as the business changes. Upstream schemas, definitions, and legitimate operating ranges can change. Review expectations deliberately; a new failure pattern could signal a source change, a stale rule, or a real data-quality issue. Updating a rule should be an intentional decision, not a way to make an inconvenient failure disappear.
Choose a failure policy that matches the risk
Validation is only operationally useful when someone has decided what to do with its results. A warning can preserve throughput while making a problem visible. Dropping invalid records can protect downstream consumers but may remove useful information. Failing a flow can prevent questionable data from propagating, but it can also interrupt dependent work. Consider the impact of each option before setting the policy.
These choices involve trade-offs, not a universal best setting. A warning or metrics-only approach helps teams observe a new issue without immediately blocking processing, but the data may continue downstream and needs an owner for follow-up. Dropping records prevents those rows from reaching later steps, but it can reduce completeness and conceal the scale of a source problem unless the outcome is recorded and reviewed. Failing a flow draws attention to a violation and contains propagation, but can delay dependent work. The failure policy should reflect the risk of the relevant data and the cost of interruption or loss.
For example, Microsoft Learn’s documentation for Databricks Lakeflow expectations describes three invalid-record outcomes: keep records with metrics under a warning behavior, drop invalid records, or fail a flow. These are product-specific options, not a universal behavior of validation tools. The documentation also notes that expectations enforce data quality but do not themselves perform general orchestration. Check the current Databricks expectation guidance for the version and runtime you use.

What to look for in a validation approach
Cleaning and validation are practices, not competing product categories. When choosing an implementation, assess whether it supports the checks and operating decisions your work actually needs. An implementation that reports schema problems may be sufficient for one task but inadequate if the use case also depends on cross-table integrity, business logic, or controlled failure handling.
- Purpose: Does it correct data, detect violations, or provide both kinds of capability? Be clear whether the requirement is to remediate known errors, test conformance, or support both activities in a wider workflow.
- Rule coverage: Can it check structure as well as values, distributions, freshness, uniqueness, relationships, and domain-specific business rules? A long list of checks is not automatically better; prioritize checks tied to the data’s intended use.
- Failure handling: Can results warn, report, retain, quarantine, drop, or stop a flow as required? What will each option mean for downstream work? Consider whether operators can tell which rule failed and what records or batches were affected.
- Repeatability and traceability: Can teams reuse rules, inspect results, and review rule changes? Great Expectations documents expectation suites, validation results, Checkpoints, and actions; Databricks recommends storing expectation definitions separately from pipeline logic for portability and maintenance. Reusable definitions make it easier to apply the same expectations consistently, while inspected results support follow-up.
- Scale and operating cost: Cross-table checks and large datasets can affect performance. Test the workload and checks you intend to run rather than assuming every rule is free. A rule with a broad scan or relationship comparison may have different operational implications from a simple required-column check, so measure on the relevant workload before relying on assumptions.
- Business ownership: Can subject-matter owners agree on what counts as correct and approve remediation rules? Software can apply a decision, but it cannot replace the decision about what a field means. Confirm who will review failures and who has authority to revise rules when definitions change.
These criteria help compare approaches without assuming that cleaning and validation are alternatives. A data-cleaning step may be implemented in a transformation process, while validation may be run at ingestion, after transformation, or on scheduled batches. The appropriate design depends on the work and risk; available documentation provides examples and practices, not a controlled comparison showing that one named tool or workflow is universally more effective.
Examples of validation tools in context
Great Expectations is one example of validation software: its documentation describes defining expectations, validating batches, reviewing results, and using production Checkpoints. It also documents connections to dataframes, files, and SQL data sources. That makes it an example of an approach, not evidence that every organization needs a separate platform.
In its documented model, expectations can be grouped into suites, a Validation Definition links a batch to those expectations, and a Checkpoint supports production workflows that can process validation results through actions such as notifications. The separation between declaring a rule and reviewing its result helps illustrate repeatable validation, but the rules still need to come from the organization’s own data requirements.

Frequently Asked Questions
Can data pass validation and still be wrong?
Yes. A dataset can pass schema checks for required columns and data types while containing values that are semantically wrong. Add relevant ranges, patterns, business rules, and relationship checks, while recognizing that validation only tests the expectations you define.
Should I clean data before or after validation?
Both stages can be useful. Profile the data and validate it against known requirements to discover issues, clean only when there is a defensible correction rule, then validate the transformed output. Repeat checks on new batches and after meaningful transformations.
What should happen when a validation check fails?
Choose a policy based on risk: report or warn, retain records while recording metrics, quarantine or drop invalid rows, or fail the affected flow. Each choice has trade-offs, so decide who investigates failures and what downstream consequences are acceptable.
Does a data validation tool fix incorrect values?
Not necessarily. Validation tools compare data with expectations and report results; a failed check does not tell the tool what value is correct. Cleaning requires an approved domain rule for correction, standardization, deduplication, filling, quarantine, or removal.
Do all datasets need a separate validation platform?
No. Great Expectations and the documented Databricks and Microsoft Fabric examples illustrate possible implementations, not a requirement for every team. Choose an approach based on needed rule coverage, failure handling, repeatability, traceability, scale, and business ownership.
The Bottom Line
Use cleaning to make approved corrections and validation to check explicit requirements. Define what the data means, inspect issues before editing, preserve traceability where it matters, and validate both transformed data and later batches. A passing check is only as meaningful as the rules behind it, and a failed check should trigger an intentional response—not an automatic guess at the right value.
