Find dirty data by measuring the fields that matter to a specific business use, not by scanning every column and calling every unusual value an error. Define explicit quality rules, profile the critical data to establish a baseline, rank failures by business importance, impact and measured shortfall, then fix root causes and repeat the same checks.
“Dirty” is a useful shorthand, not a technical classification. In practice, data is dirty when it fails a documented rule for its intended use. A blank value may be a defect in a required payment field, but entirely appropriate in a field that does not apply to a particular customer. A populated value may pass a completeness check while still being factually wrong.

Start with the decision the database must support
The purpose of the data determines what quality means. A customer table used to calculate loan affordability has different critical fields from an event log used to monitor system uptime. The same column can be high priority in one use and unimportant in another.

Write a one-sentence use case
Before running a profile, state what decision, process or report the data supports. Examples include:
- Calculate monthly household cash flow from categorized transactions.
- Send legally required notices to customers at their current addresses.
- Reconcile invoices, payments and refunds between systems.
- Produce a regulatory report by a fixed submission date.
Record the users, decision deadline, acceptable risk and consequences of a wrong or late value. This context becomes the basis for selecting critical tables and fields.
Map the critical data path
Trace the data from collection through transformations to the final report or action. Mark the tables, columns, keys and relationships that can change the outcome. Include reference tables, derived fields and timestamps; a clean-looking output can still be wrong if an upstream join or conversion is defective.

Define “fit for purpose” as testable rules
Work with data owners, users and stewards to turn expectations into rules that can be measured. Each rule should name the scope, condition, target, measurement period and exception policy.
Required-value rules
Specify which records require a value and distinguish null, empty, whitespace-only and structurally absent values. For example, an account’s country may be required for tax reporting, while a middle name may be optional. Document legitimate missingness instead of automatically counting it as an error.
Format, domain and range rules
Define permitted formats and enumerated values: an ISO country code, a currency code, a date-time convention or an allowed account status. Set numeric boundaries that reflect the domain. A negative refund may be valid in a reversal process, while a negative account balance may be either valid overdraft data or a sign error depending on the product.

Uniqueness rules
Identify keys that must be unique and the combinations that identify an entity. Decide whether repeated rows are invalid or represent legitimate events, such as multiple payments for one account. A duplicate customer record and a repeated transaction are different problems.
Cross-field and cross-table rules
Specify relationships that must agree. Examples include a transaction currency matching its account, a closed account having a closure date, a refund referencing an existing payment, or a child record pointing to a valid parent key. These checks often reveal defects that column-by-column tests miss.
Freshness rules
Set an age limit based on the use: a daily report may require data less than 24 hours old, while an annual archive may have a different requirement. Measure the timestamp that represents business freshness, not merely the time a row was loaded into a warehouse.
Accuracy rules
Define how values can be compared with an authoritative source, a verified reference file or domain knowledge. Plausible formatting and ranges cannot prove that a name, balance or address is true. Statistics Canada’s Process quality guidelines and the Government of Canada’s Guidance on Data Quality both treat accuracy as distinct from completeness and other dimensions.

Use a dimension vocabulary, but do not apply it blindly
A shared vocabulary helps teams describe defects consistently. The GDS implementation guide identifies six core dimensions: completeness, uniqueness, consistency, timeliness, validity and accuracy. The guide is available at Implementing a data quality action plan.
| Dimension | What to measure | Typical database evidence | Important qualification |
|---|---|---|---|
| Completeness | Whether required records or values are present | Null, blank or absent required values; missing records in an expected period | Expected or structural missingness may be valid. |
| Uniqueness | Whether entities or keys occur only as intended | Duplicate key or duplicate-entity counts | Repeated event rows may be legitimate under the data model. |
| Consistency | Whether values agree within and across data assets | Contradictory statuses, totals, dates or linked-table relationships | Define which source is authoritative when systems disagree. |
| Timeliness | Whether data is current enough for its use | Age of the newest and oldest relevant timestamps; late-arriving records | The threshold depends on the decision deadline. |
| Validity | Whether values conform to permitted formats, domains and ranges | Pattern, enumeration and boundary failures | A valid-looking value can still be inaccurate. |
| Accuracy | Whether data corresponds to real entities or events | Comparison with trusted source data or verified domain evidence | Profiling alone cannot establish truth. |
Canada’s 2024 guidance uses nine dimensions—access, accuracy, coherence, completeness, consistency, interpretability, relevance, reliability and timeliness. That broader list includes concerns about users’ ability to understand and access data, not just field-level defects. The difference is useful: dimensions are a vocabulary, not a universal checklist. Choose the dimensions and operational rules that fit the use and the data lifecycle.
Profile critical data to establish a baseline
Profiling is a measurement snapshot, not a verdict about truth. For each selected table and field, calculate the statistics that correspond to your rules and save the scope, filters, timestamp and rule version with the result.

Measure the failures your rules describe
- Completeness: count required null, blank and absent values, then divide by the applicable population. Exclude fields that do not apply by design.
- Uniqueness: count duplicate keys and likely duplicate entities using the documented key or matching logic. Review whether each repeated row violates the model.
- Validity: count values outside allowed ranges, formats or enumerations. Report the failing values or categories so an owner can investigate.
- Consistency: compare related fields and linked tables for contradictions, missing parents, mismatched totals or impossible sequences.
- Timeliness: calculate age against the freshness rule and count records outside the permitted window.
- Accuracy: compare a defined sample or full population with an authoritative source where one exists; record the source’s date and coverage.
Column profiling in Microsoft Purview, for example, produces a statistical snapshot after you select columns to profile. Its workflow is documented in Configure and Run Data Profiling in Unified Catalog. That documentation confirms the selection-and-snapshot pattern; it does not establish that one product is appropriate for every database.
Capture a baseline record
For every metric, retain:
- Table, column or relationship checked.
- Rule identifier and rule text.
- Population definition, exclusions and sampling method.
- Measurement date, time zone and data refresh status.
- Observed count, denominator and percentage.
- Target, tolerance and severity interpretation.
- Query or job version and the person or team responsible.
A percentage without its denominator can mislead. “One percent invalid” means something different in a table of 500 rows than in one containing 500 million. Keep counts alongside rates.
Protect production performance and data access
The exact query syntax, indexes, sampling strategy and safe execution plan depend on the database engine and schema. Profile a read replica, warehouse copy or controlled time window where appropriate; obtain the least privilege needed; and avoid exporting sensitive values when aggregates or masked samples are sufficient. Test expensive cross-table checks before scheduling them against a production workload.
Prioritize by consequence and measured shortfall
Raw defect counts are a poor queue. A handful of wrong values in a field that drives a high-impact decision can matter more than thousands of harmless exceptions in an optional field. Conversely, a severe failure in a low-impact field may reasonably wait.
The GDS Data quality issues framework, updated 16 April 2026, offers one way to make the trade-off explicit. It combines an importance-impact score with a performance band. Treat it as a proposed framework, not a mandatory or cross-industry standard.
Calculate the example priority score
- Assign an importance score for how central the affected data is to the use case.
- Assign an impact score for the consequence if the defect remains.
- Multiply importance by impact to create the consequence score.
- Place the measured performance against the target in the framework’s performance band and assign its performance score.
- Multiply consequence score by performance score to obtain the issue priority score.
- Use the resulting band to set urgency and resources, then document why the ratings were chosen.
| Priority score | GDS example band | Meaning for triage |
|---|---|---|
| 1–7 | Low | Monitor or schedule after higher-consequence work. |
| 8–16 | Medium | Assign an owner and plan corrective work. |
| 17–32 | High | Commit near-term resources and escalation. |
| 33–64 | Critical | Act urgently and consider containment of affected outputs. |
These ranges and ratings are the figures published in the 2026 GDS framework. They are not prevalence statistics and should not be presented as a universal benchmark.
Worked example from the framework
Suppose a rule requires 95% completeness. The observed result is 94.2%, a small shortfall. In the GDS example, importance is 2 and impact is 2, producing a consequence score of 4. The performance result receives a score of 1, so the final score is 2 × 2 × 1 = 4, which falls in the Low band. The same 94.2% result could deserve a higher response if the field supported a safety-critical or legally binding decision; the context changes the importance and impact inputs.

Make the ranking auditable
For each issue, show the rule, target, current result, denominator, affected records, importance rationale, impact rationale, performance band, score, owner and due date. Have the data owner and business user approve the consequence ratings. This prevents a mathematically neat score from hiding an unexamined assumption.
Investigate the cause before correcting rows
A profile tells you where the pattern is; it rarely tells you why it exists. Group failures by source system, ingestion batch, date, operator, code path, product or transformation step. Compare a failing sample with a passing sample while protecting sensitive data.

- Collection: a form permits an invalid value, a required field is not enforced, or users interpret a label differently.
- Integration: field mappings, time zones, encodings or reference codes differ between systems.
- Transformation: a join multiplies rows, a conversion truncates values, or a filter drops records.
- Reference data: code lists change without versioning or a lookup table is stale.
- Operations: a failed batch, delayed feed or partial retry leaves an incomplete load.
- Governance: ownership, definitions or exception handling are unclear.
Choose a corrective action
Contain the immediate risk first: quarantine a failed batch, flag an affected report, or prevent a known-invalid value from entering a downstream process. Then fix the source where possible. A one-time cleanup without a source correction usually recreates the defect.
For every issue, assign one accountable owner, a correction method, an acceptance test and a date for remeasurement. Preserve an audit trail of changed records and the rule version used to approve the fix.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.Repeat the same measurements and communicate change
After remediation, rerun comparable checks with the same population definition, exclusions and calculation logic. If a rule changes, keep the old result and label the new rule rather than presenting an artificial improvement.
Report results in context:
- What rule was tested and why it matters.
- Target, current value, count and denominator.
- Trend from the prior comparable run.
- Affected tables, products, reports or decisions.
- Owner, action, due date and residual risk.
- Known limitations, such as incomplete reference coverage or sampled accuracy checks.
Repeated measurement supports trend analysis. A falling defect rate may reflect a real improvement, a changed denominator, a delayed feed or a narrower filter, so explain material changes rather than relying on a single percentage.

Know the traps that make dirty-data programs fail
Treating every null as bad
Separate not-applicable, intentionally withheld, not-yet-received and erroneous missing values. Apply the rule only to the population for which the field is required.
Confusing completeness with accuracy
A filled-in address can be obsolete or fabricated. A missing optional field can be correct. Use authoritative comparisons or domain review for accuracy; do not infer truth from a profile’s formatting statistics.
Ranking by volume alone
Defect volume ignores consequence. Use the importance, impact and performance logic described above, and document exceptions when a legal, safety or deadline constraint overrides the numerical band.
Free tools Windows power users keep installed
One-click scans. No signup required.
Scanning everything before understanding the use
Broad scans generate noise, consume resources and encourage teams to fix easy low-impact anomalies. Start with critical data and expand only when findings show a dependency that affects the use case.
Changing the rule to improve the chart
Version rules and preserve historical results. A target should change because the use, risk or policy changed, not because the current result is inconvenient.
Fixing the warehouse copy only
If the collection form, source application or integration mapping remains defective, the next load will reintroduce the issue. Include preventive controls and ownership at the earliest practical point in the data path.
Choose a profiling approach on operational fit
The title does not identify a database engine or a preferred tool. Compare any profiling approach or product on the capabilities that determine whether findings will be useful:
- Supported database and source types, including the systems in your critical data path.
- Rules and dimensions available, and whether you can define your own thresholds.
- Selection of critical columns instead of mandatory full-database scans.
- Cross-table, relationship and business-rule checks.
- Scheduled reruns, trend history and alerts.
- Permissions, masking, retention and data-handling controls.
- Performance impact, concurrency controls and options for sampling or replicas.
- Explainability: the failing records, rule, denominator and calculation behind each result.
- Total operational cost, including implementation, storage, support and stewardship time.
A tool can automate measurement, but it cannot decide which data matters, what an acceptable exception is or how a business consequence should be scored. Those decisions belong to the people who understand the use case and its risks.
A repeatable runbook
- Describe the use: name the decision, users, deadline and consequence of bad data.
- Map critical assets: identify tables, fields, keys, relationships and timestamps that influence that use.
- Agree rules: define requiredness, uniqueness, validity, consistency, freshness and accuracy checks with targets and exceptions.
- Profile safely: run the appropriate aggregates and relationship checks in a controlled environment and save the baseline metadata.
- Validate findings: inspect representative failures and confirm that they are genuine rule violations, not legitimate edge cases.
- Score and rank: apply consequence and performance ratings, using the GDS bands only as an example framework.
- Assign action: contain immediate risk, identify the root cause, name an owner and set an acceptance test.
- Prevent recurrence: improve source validation, mappings, reference-data controls or operational monitoring.
- Rerun and report: repeat comparable measurements, explain changes in scope or rules, and keep unresolved limitations visible.
This approach turns “dirty data” from a vague complaint into a controlled improvement cycle: a use-specific definition, measurable evidence, an auditable priority and a verified correction.
