You can cut GPU cloud costs without slowing an AI service by improving utilization before reducing capacity, matching GPU memory and precision to the model, and scaling on queue and latency signals rather than CPU or raw GPU percentage alone. The safest sequence is to measure demand, test a cheaper configuration against a fixed quality and latency budget, remove idle replicas, use interruption-tolerant pricing only where retries are safe, and commit to capacity only after the baseline is stable.
There is no universal cost-per-token or “ideal” GPU-utilization percentage. Prompt length, generated tokens, concurrency, batching, model architecture, region, and service-level objectives (SLOs) determine the economics of each deployment.

1. Measure the workload before changing capacity
Two deployments serving the same model can need different infrastructure. AWS identifies prompt length, response length, concurrency, and latency objectives as factors that change inference sizing. Capture a representative baseline for at least several traffic cycles before moving to a smaller GPU or a cheaper purchasing mode.
Record the metrics that affect both speed and spend
| Metric | What it reveals | How to use it |
|---|---|---|
| GPU duty cycle | How often the accelerator is doing work | Low duty cycle suggests idle capacity or poor request packing; high duty cycle with a growing queue suggests more capacity or better batching is needed. |
| GPU memory used and peak headroom | Whether the model, key-value cache, and batches fit safely | Use peak, not average, memory when testing a smaller GPU or higher batch size. |
| Queue depth and queue age | How much demand is waiting and for how long | These are direct autoscaling inputs for asynchronous and many online inference services. |
| Batch size and batch-formation delay | Whether requests are being combined efficiently | Increasing batches can raise throughput, but excessive waiting can violate time-to-first-token or end-to-end latency SLOs. |
| Tokens per request | How much prompt and generation work each request creates | Separate prompt and output-token distributions; averages hide long-tail memory and latency requirements. |
| Concurrency | How many requests compete for the model at once | Test at expected peak concurrency, not only with a single request. |
| Throughput | Requests or tokens completed per unit of time | Compare throughput per dollar after each configuration change. |
| Time to first token (TTFT), p50 and p95 latency | Interactive responsiveness and tail behavior | Keep percentile measurements within the SLO; a faster median does not compensate for a slow p95. |
| Error rate and out-of-memory events | Whether the configuration is reliable under load | Reject any change that saves money by increasing failed or retried work. |
| Interruption and restart behavior | How safely the workload can run on preemptible capacity | Measure checkpoint time, recovery time, and lost work before using Spot resources. |
Tag the measurements by model, version, environment, team, and tenant. Without those dimensions, a lower bill can conceal a model that became slower or a team that is subsidizing another team’s idle capacity.

2. Right-size the accelerator and precision
Choose the accelerator from the model’s actual memory and compute requirements, not from a familiar instance type. The sizing decision must include model weights, precision, maximum prompt and response lengths, key-value cache growth, concurrency, batch size, and the latency SLO.
Test a smaller or newer GPU against a fixed budget
- Create an evaluation set that represents production prompts, output lengths, safety checks, and quality criteria.
- Define hard limits for TTFT, p50 and p95 end-to-end latency, throughput, error rate, and peak memory.
- Benchmark the current GPU and at least one lower-cost family at the same concurrency and traffic mix.
- Run the candidate through the evaluation set and a sustained load test; record throughput per dollar rather than throughput alone.
- Canary the candidate with a small share of live traffic and keep the previous configuration ready for rollback.
A cheaper GPU that lacks memory headroom may trigger out-of-memory failures, force a smaller batch, or increase queueing enough to cost more in retries and replicas. Conversely, a newer accelerator can be cheaper per completed token even when its hourly price is higher if it finishes work faster.
Use lower precision only after quality and latency checks
AWS lists FP16, FP8, INT4, and NVFP4 as common inference formats. Lower precision can reduce memory requirements and improve throughput, but the effect depends on the model and kernels used by the serving stack.
What’s actually slowing this PC down?
Pick the symptom - the matching free tool is one click away.
| Format family | Potential benefit | Required validation |
|---|---|---|
| FP16 | Broad compatibility and a common quality baseline | Measure memory, throughput, and quality as the reference configuration. |
| FP8 | Lower memory use and potentially higher throughput on supported hardware | Check hardware and framework support, numerical stability, and task quality. |
| INT4 | Substantially smaller weights and lower memory pressure | Evaluate factual accuracy, tool use, safety behavior, and long-context performance. |
| NVFP4 | Very low-precision option on compatible NVIDIA platforms | Confirm platform support and compare quality and tail latency on the exact model. |
Do not infer quality from a format name. Quantization can affect different layers and tasks unevenly, so use the same offline tests and production canary gates as for a hardware change.
3. Raise utilization before buying more GPUs
When GPUs are lightly loaded, improve the amount of useful work each running replica performs before adding capacity. Microsoft identifies caching, batching, routing, model selection, right-sizing, scale-to-zero, reservations, quantization, and per-tenant controls as complementary cost levers.

Cache repeatable work
Prompt caching can avoid recomputing shared prefixes, while semantic caching can reuse answers for sufficiently similar requests. Define invalidation rules, tenant boundaries, privacy controls, and a quality threshold. A stale or cross-tenant cache hit is a correctness and security failure, not a saving.
Batch requests without violating the SLO
Dynamic batching combines requests arriving close together. Set both a maximum batch size and a maximum batch-formation wait. Increase the batch only while TTFT, p95 latency, memory headroom, and error rate remain within limits. Streaming responses need special care because a long batch can delay the first token even when total throughput improves.

Random freezes, missing sound and display glitches usually trace back to one bad driver. Find and replace yours safely.Free scan · under a minuteRoute each request to the least expensive model that meets its requirement
Use a smaller default model for routine requests and route difficult prompts, long contexts, or low-confidence outputs to a larger model. Establish routing rules from an evaluation set rather than from request length alone. Track quality and cost by route so a high fallback rate is visible.
Control noisy tenants and unbounded requests
Apply per-tenant concurrency limits, token budgets, maximum context lengths, and rate limits. These controls prevent one workload from forcing every replica to remain overprovisioned. Return a clear, retryable response when a tenant exceeds its budget instead of allowing unbounded queue growth.
4. Share one physical GPU safely with MIG
NVIDIA Multi-Instance GPU (MIG) partitions a supported physical GPU into isolated instances that run workloads in parallel. NVIDIA documents configurations with up to seven GPU instances on supported Blackwell and Hopper systems. This is useful when several smaller inference, development, or mixed workloads would otherwise leave a full accelerator idle.

When MIG is a good fit
- Several services have predictable, moderate memory footprints.
- Workloads need isolation from one another but do not require the full GPU.
- Development, testing, or small inference endpoints would waste a whole accelerator.
- Capacity can be divided into profiles that match each model’s peak memory and compute needs.
What to validate before rollout
- Peak model and key-value-cache memory in each MIG profile.
- Kernel and framework support for the selected GPU generation.
- Latency and throughput when neighboring instances are busy.
- Startup, reconfiguration, and failure-recovery behavior.
- Tenant isolation, observability, and quota enforcement.
MIG is not a universal replacement for a full GPU. A model that needs the entire memory pool, benefits from large shared batches, or has strict tail-latency requirements may perform better on a dedicated accelerator.
5. Autoscale on workload signals, not CPU alone
GPU utilization tells you how busy an accelerator is, but not how much useful work it completes while active. CPU-only autoscaling can miss a GPU-bound queue entirely. Google recommends queue-size autoscaling when the goal is throughput and cost and the model server can meet the latency target at its maximum batch size. For tighter latency targets, Google recommends batch-size autoscaling.
Choose the signal that matches the service objective
| Workload objective | Primary signal | Why | Guardrails |
|---|---|---|---|
| Maximize throughput at an achievable latency target | Queue size or queue age | Directly reflects waiting work and adds replicas before backlog becomes a user-visible delay. | Set a target queue age, maximum replicas, and a scale-in stabilization window. |
| Keep interactive latency very tight | Batch size, TTFT, and p95 latency | Controls how much work is packed without allowing batching delay to dominate. | Cap batch wait, protect a warm baseline, and scale out before p95 breaches the SLO. |
| Long-running batch inference | Queue size, remaining items, or job completion time | Matches capacity to the amount of unfinished work. | Use checkpointing and a deadline-aware maximum replica count. |
| GPU-bound but irregular workloads | GPU duty cycle plus queue and latency | Combines accelerator pressure with actual user impact. | Do not use utilization alone; validate the relationship during load tests. |
Set scale-out and scale-in behavior separately
Scale out should react quickly enough to prevent queue-age or p95 violations. Scale in should be slower, with a stabilization period, so short traffic gaps do not cause repeated model unload and reload cycles. Set a minimum replica count based on cold-start time and the latency SLO, not habit.
6. Turn idle capacity off without creating cold-start failures
Bursty endpoints can use scale-to-zero or an aggressive minimum-replica policy. The trade-off is model-load latency: downloading weights, initializing kernels, and warming caches can make the first requests slow.
Use a warm baseline only where it earns its cost
- Keep one or more warm replicas when cold-start latency would breach the SLO.
- Scale to zero for development, scheduled jobs, and endpoints with predictable idle windows.
- Use traffic forecasts to pre-warm capacity before known peaks instead of keeping it running all day.
- Store model weights on fast, durable storage so a new replica starts predictably.
- Measure cold-start duration, first-request latency, and failed requests during scale transitions.
A minimum replica is a recurring expense. Revisit it after traffic changes, model upgrades, and changes to weight size; a baseline that was necessary for one version may be wasteful for another.

7. Match the purchasing mode to interruption risk
Price reductions are valuable only when the workload can tolerate the capacity’s failure mode. Google documents Spot resources, including GPUs, with discounts of up to 91% in its 2026 AI Hypercomputer documentation. It documents Flex-start resources with discounts of up to 53% on listed machine series. Microsoft describes Azure Spot VMs as offering up to 90% savings versus pay-as-you-go prices. These are maximum published discounts, not guaranteed prices or availability.
| Capacity option | Best use | Strength | Risk or limitation |
|---|---|---|---|
| Spot | Checkpointed training, fine-tuning, batch inference, analytics, and CI | Potentially the largest discount; Google cites up to 91% and Microsoft up to 90% for their respective offerings. | Preemption, regional scarcity, restart work, and variable availability. |
| Flex-start | Short workloads that can start flexibly | Google cites discounts up to 53% on listed machine series. | Start timing is less certain; unsuitable for an immediate interactive SLO unless another capacity tier covers it. |
| On-demand | Interactive production serving and urgent capacity | Immediate, predictable access without a long commitment. | Highest unit price and exposure to idle time. |
| Reservations or savings plans | Stable, long-lived baseline demand | Lower effective price for committed usage. | Commitment risk if traffic, model mix, region, or GPU generation changes. |
Interactive inference generally belongs on reliable on-demand or committed capacity unless an interruption-aware architecture has demonstrated that users will not see unacceptable delays. Training and batch workloads can place more capacity on Spot when they resume safely.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.8. Make interruption-prone jobs restartable
Spot savings are illusory if a preemption discards hours of work or causes a missed deadline. Before moving a job, document how much work can be lost and how long recovery takes.
- Write checkpoints to durable storage at a frequency that fits the acceptable rework window.
- Store model state, optimizer state, data position, random seeds where reproducibility matters, and the software version needed to resume.
- Use idempotent job identifiers so a retry cannot duplicate outputs or charge a downstream system twice.
- Detect interruption notices and stop accepting new work before shutdown when the platform provides advance warning.
- Retry with bounded exponential backoff and a fallback capacity class.
- Monitor completion time, retry count, lost work, and effective cost per completed job.
Keep latency-critical serving on reliable capacity until this process has passed a production canary. A lower hourly rate does not offset missed SLOs, duplicate work, or customer-facing downtime.
Do these 3 things before closing this tab:
1Scan for outdated or missing drivers - takes under a minute2Clear out junk files and repair common Windows errors3Fix the driver behind crashes, sound loss and screen glitches9. Commit only the predictable baseline
After several weeks of stable measurements, separate demand into a predictable floor and an elastic peak. Commit reservations or savings plans only for the floor. Leave spikes on flexible or on-demand capacity so a forecast error does not create an expensive unused commitment.

Review the whole cost surface
- Region: GPU availability, price, quota, and data-residency requirements can differ.
- Accelerator generation: a newer GPU may deliver more completed work per billed hour.
- Network: cross-zone or cross-region traffic can erase an accelerator discount.
- Storage: repeated model downloads, snapshot storage, and checkpoint traffic add recurring charges.
- Throughput: a low hourly price is poor value if batching, memory pressure, or kernel support lowers completed work.
- Operational complexity: extra profiles, regions, or fallback paths consume engineering time and can increase failure risk.
Compare configurations using throughput per dollar, p50 and p95 latency, TTFT, memory headroom, model quality, startup time, interruption probability, regional availability, operational complexity, and commitment length. No single metric captures the decision.
10. Install a safe-change loop
Cost optimization should be an operating process, not a one-time resize. Microsoft describes cost optimization as maximizing resource value while minimizing unnecessary expense. Make every change observable and reversible.
- Define the guardrails. Write the quality threshold, TTFT, p95 latency, throughput, error-rate ceiling, memory limit, and interruption tolerance.
- Measure the current state. Capture the metrics in the same traffic mix and label spend by team, model, environment, and tenant.
- Change one major variable. For example, test precision before changing GPU family, or batching before changing autoscaling.
- Run offline evaluation. Reject configurations that reduce answer quality, safety performance, or tool reliability.
- Canary under live load. Compare p50, p95, TTFT, queue age, throughput, errors, and cost per completed request with the control.
- Review the error budget. Do not spend the reliability budget to achieve a small nominal saving.
- Roll back automatically when a guardrail fails. Keep the prior image, model, scaling policy, and capacity class available.
- Verify the bill after deployment. Check that savings appear in actual usage and were not offset by retries, storage, transfer, or idle replicas.
11. Troubleshoot common cost-cutting failures
The smaller GPU is slower despite lower utilization
Check whether the model moved from compute-bound to memory-bound behavior, whether the batch size fell, and whether kernel support changed. Compare completed tokens per dollar and p95 latency, not utilization alone. Restore the larger GPU if queue age or tail latency breaches the SLO.
Quantization caused quality regressions
Identify which tasks and context lengths fail, then test a less aggressive format or selective higher precision for sensitive layers. Keep the quantized model only if the measured quality remains within the agreed threshold.
Autoscaling oscillates between replicas
Increase the scale-in stabilization window, separate scale-out and scale-in thresholds, and account for model-load time. A controller that removes a replica before its replacement is ready can create a repeating cold-start cycle.
GPU utilization is high but users see idle time
Inspect queue age, batch-formation delay, memory pressure, and token throughput. A GPU can be busy with inefficient kernels or one oversized request while other requests wait. Improve batching or routing before adding replicas.
Spot savings disappear from retries
Calculate lost work, checkpoint frequency, restart time, and fallback usage. If the effective cost per completed job is not lower, move the job to a more reliable tier or checkpoint more frequently.
A reservation becomes stranded
Compare committed capacity with the current model mix, region, and accelerator generation. Commit only the measured baseline and review commitments before migrations or model changes.
Quick Recap
12. A practical decision path
- Is demand predictable? If yes, reserve or use a savings plan for the measured floor; if no, keep the peak elastic.
- Is the workload interruption-tolerant? If yes, evaluate Spot or Flex-start with checkpointing; if no, use reliable capacity.
- Is memory the constraint? If yes, test precision, context limits, batching, and a GPU with the right memory headroom before reducing size.
- Are replicas idle? If yes, add caching, batching, routing, MIG, or scale-to-zero before purchasing more GPUs.
- Are users waiting? If yes, scale on queue age, batch size, TTFT, and p95 latency; do not rely on CPU-only signals.
- Did the change pass quality, latency, reliability, and billing checks? If not, roll back and isolate the failed assumption.
