How to reduce AI infrastructure costs with autoscaling and scheduled shutdowns

The dependable way to lower AI infrastructure spend is to match capacity to demand at two separate layers. Use HPA or KEDA to change model-serving replicas from application demand, then use a node autoscaler such as Cluster Autoscaler or Karpenter to add, remove, or consolidate the CPU and GPU nodes those replicas need. Add calendar-based shutdowns for development, test, preview, notebook, and batch environments, and scale intermittent inference to zero when its cold-start delay is acceptable.

Measure cost together with latency, availability, throughput, cold starts, and interruption events. Right-size resource requests, protect pods that cannot be evicted safely, label every workload for cost allocation, and reserve capacity only for the predictable baseline. This approach cuts idle capacity without making an accidental trade of a lower bill for missed service-level objectives.

Why AI infrastructure costs stay high

GPU and CPU capacity is usually billed while it is allocated, not only while a model is processing a request. A service that needs ten replicas during a traffic burst can leave those replicas, and their nodes, running through quiet periods unless an explicit policy scales them down. The same problem appears in development clusters, preview environments, notebooks, and scheduled pipelines that operate only during part of the week.

There are two different resources to control:

  • Workload capacity: model-server replicas, workers, or jobs. This layer responds to requests, queue depth, latency, concurrency, or token throughput.
  • Node capacity: the virtual machines and GPU nodes that host those pods. This layer provisions capacity when pods cannot be scheduled and consolidates or removes it when capacity is no longer needed.

Changing only replicas can leave empty GPU nodes running. Changing only nodes cannot remove replicas that still request capacity. Savings come when both controllers are coordinated.

How the two autoscaling layers interact

For a GPU inference service, the sequence is normally:

  1. HPA or KEDA observes a configured application metric and changes the model-server replica count.
  2. If new replicas are pending because existing nodes cannot fit them, the node autoscaler provisions suitable GPU nodes.
  3. When demand falls, the workload scaler reduces replicas.
  4. The node autoscaler detects that nodes are no longer needed and removes or consolidates them, subject to scheduling constraints and eviction protections.

Kubernetes describes node autoscaling as automatically provisioning and consolidating nodes to adapt to demand and optimize cost. A pending pod is the signal to add capacity; a node that no longer contributes useful schedulable capacity becomes a consolidation candidate.

Choose a policy for the workload’s demand shape

Autoscaling is not one universal setting. Start by classifying when demand occurs, how quickly it changes, and how much startup delay users can tolerate.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
Demand shape Primary control When it saves money Main trade-off
Steady baseline Fixed minimum replicas plus reserved or savings-plan capacity Capacity is used consistently enough to justify a committed baseline Commitments can leave you paying for capacity when the forecast is wrong
Bursting or unpredictable traffic HPA or KEDA with a node autoscaler Replicas and nodes follow short-lived peaks instead of being sized for the maximum Scale-out delay and temporary overprovisioning must be monitored
Periodic traffic with a known calendar Scheduled scaling or scheduled shutdown Night, weekend, or other known idle windows do not keep clusters running A calendar exception is needed when an event falls outside the schedule
Sporadic event-driven inference KEDA scale-to-zero with a queue or request metric No serving replicas or GPU nodes remain between events The first request waits for a cold start and model loading
Interruptible batch work Flexible-start scheduling and elastic or interruptible capacity Jobs run when lower-cost capacity is available and do not require an exact start time Completion time and interruption risk are less predictable

Use application metrics, not CPU alone, for GPU inference

CPU utilization is often a poor proxy for an accelerator-backed model server. A GPU can be saturated while host CPU looks quiet, or a model can reserve a large GPU while serving very few requests. Scale from the signal that represents the work users are actually generating.

Useful demand signals

  • Inference request rate: scale when requests per second rise and scale down after demand remains low.
  • Queue depth: add replicas when work is waiting, particularly for asynchronous APIs and batch workers.
  • Latency: use a target response time when maintaining an SLO matters more than a fixed replica count.
  • Concurrent requests: useful when each replica can process only a limited number of simultaneous calls.
  • Token throughput: a direct signal for large-language-model serving; AWS guidance specifically documents inference requests and token throughput as KEDA metrics.

Set stabilization and cooldown windows so a brief metric spike does not create a costly scale-out followed immediately by scale-in. Cooldown periods also give a newly started model time to load weights and begin serving before another decision is made.

Pair demand metrics with service objectives

Before changing a policy, record the latency target, availability objective, expected throughput, and acceptable cold-start time. A cheaper configuration that regularly violates those objectives is not a successful optimization. Keep a minimum replica count where an always-ready response is required; use zero only where the startup delay is an explicit product decision.

Schedule shutdowns where idle time is predictable

Calendar controls are the simplest cost lever when a team knows that an environment is not needed during certain hours. AWS documents scaling nonproduction clusters down for weekends and off-hours, including scaling them to zero. Azure recommends automatic shutdown for idle AI infrastructure, especially development and test environments.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Good candidates

  • Development and test clusters with working hours that can be agreed in advance.
  • Preview or temporary environments created for a project or release.
  • Notebook and experimentation pools that are used during scheduled sessions.
  • Batch pipelines with a known run calendar.
  • GPU or TPU events planned in advance, where calendar scheduling can allocate capacity for the event and release it afterward.

When scale-to-zero is better than a calendar

Use event-driven scale-to-zero when requests arrive irregularly and a calendar cannot predict the idle period. Azure’s AKS guidance identifies sporadic event-driven workloads, periodic machine-learning or GPU jobs, and dev/test or low-traffic environments as KEDA scale-to-zero candidates. Google Cloud’s GKE tutorial demonstrates GPU model servers that automatically reduce to zero pods while idle.

Scale-to-zero does not mean free infrastructure in every design. The control plane, storage, networking, logging, and other attached resources may remain billable. Google Cloud specifically reminds operators that GKE, GPU, and Pub/Sub resources are billable and should be cleaned up when they are no longer needed.

Keep exceptions explicit

Do not apply a blanket shutdown to stateful services, production endpoints with strict latency objectives, or workloads that perform critical background work. Document the owner, schedule, timezone, and exception for every environment. A schedule that silently stops a shared service creates operational cost elsewhere when engineers must restore it during an incident.

Right-size requests before adding more automation

Schedulers make decisions from Kubernetes resource requests and allocatable capacity. If a pod requests substantially more CPU, memory, or GPU than it needs, the scheduler may place fewer pods per node and the node autoscaler may add expensive capacity unnecessarily. If requests are too small, pods compete for resources and latency or availability suffers.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Review requested versus allocatable CPU, memory, and GPU for each workload. Compare those values with observed usage and with the model’s actual memory footprint, including loading time and peak serving requirements. Apply the corrected requests before judging an autoscaler’s efficiency; otherwise, the policy is optimizing inaccurate inputs.

Protect critical pods while allowing consolidation

Node consolidation works by moving or evicting pods when another arrangement can run the workload with less capacity. That is valuable for cost, but eviction can be disruptive for a model that takes a long time to load or for a service without enough replicas.

Test consolidation in nonproduction first. For a pod that is expensive or unsafe to evict, Kubernetes supports the annotation cluster-autoscaler.kubernetes.io/safe-to-evict=false. Use this sparingly: protecting every pod prevents the node autoscaler from removing idle capacity and can turn a cost control into a permanent reservation.

Use replica minimums, disruption budgets, and scheduling constraints to express the service’s real availability needs. Verify that a replacement pod can become ready before the old pod is removed, especially when GPU initialization or model loading is slow.

Tune scale-down conservatively

Aggressive scale-down can create a loop: a node is removed, a replacement is immediately needed, and the cluster pays for repeated provisioning and model loading. Conservative settings reduce that churn while still removing genuinely idle capacity.

AWS documents a default Cluster Autoscaler scale-down utilization threshold of 50% and a default unneeded time of 10 minutes. Treat those as starting points, not universal answers. Test any change against workload latency, pending-pod time, scale events, cold starts, and cost. A lower utilization threshold may remove more nodes but increase the chance of disruption; a longer unneeded time can reduce churn but keeps idle capacity running longer.

A practical rollout plan

Implement the controls in an order that makes financial results measurable and operational risk manageable.

Designing a GPU inference policy

Keep the minimum warm capacity intentional

Decide whether the endpoint needs an always-ready replica. A minimum of zero maximizes idle-time savings but exposes users to model-loading delay. A small minimum preserves responsiveness for a known baseline while allowing bursts to scale out. Record that decision as an SLO and capacity assumption rather than letting a default replica count become permanent.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Use KEDA or HPA for the serving layer

Configure the scaler around the model’s work signal. For a token-generating service, token throughput may represent load better than CPU. For an asynchronous service, queue depth can reveal pressure before latency increases. Set a cooldown long enough for requests to drain and for the model to reach a stable serving state after scale-out.

Use Karpenter or Cluster Autoscaler for GPU nodes

When the replica scaler creates pending pods, the node autoscaler must select nodes with enough GPU type, memory, and other scheduling attributes. When replicas fall, it should consolidate nodes only when the remaining pods can be placed safely. Watch pending-pod duration and node provisioning time; a policy that scales replicas quickly but waits too long for GPU nodes can violate latency objectives even when the metric is correct.

Choose capacity commitments for the predictable baseline

Reservations and savings plans fit capacity that is expected to run consistently. They can cover the minimum production footprint while autoscaling handles bursts above that baseline. Do not use a long commitment to cover development, test, or highly intermittent GPU demand simply because the workload once reached a high peak.

Elastic or interruptible capacity is better suited to flexible jobs whose start time or completion time can move. Google Cloud describes flexible-start scheduling for batch jobs whose start time can move and calendar scheduling for planned GPU or TPU events. Match those options to the job’s deadline and interruption tolerance rather than treating the lowest hourly rate as the only criterion.

  • Scale-out and scale-in events, provisioning time, and cold-start duration.
  • Latency, availability, throughput, and SLO violations.
  • Interruption and eviction events, including workloads protected from eviction.

Resource labels and Kubernetes cost-reporting tools make this attribution possible. Without ownership labels, a lower cluster bill may hide a team’s increased usage or make it impossible to identify which policy caused a service regression.

Common failure modes and fixes

The GPU is idle but the bill is not falling

Check whether replicas have scaled down and whether the node autoscaler is allowed to remove the now-empty nodes. Large requests, anti-affinity rules, daemon workloads, or an eviction-protection annotation can leave a node non-consolidatable even when its GPU utilization is low.

Scaling follows CPU while users wait

Replace CPU-only scaling with request rate, queue depth, latency, concurrency, or token throughput. CPU can remain low while the accelerator is saturated, so it may not react until the service is already slow.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Scale-to-zero causes unacceptable first-request latency

Increase the minimum warm replicas, lengthen the cooldown, or reserve a small baseline. Keep zero replicas for paths where the product explicitly accepts model-loading delay.

Nodes churn during traffic fluctuations

Increase stabilization or unneeded windows, review the 50% utilization starting point, and check whether a burst metric is too sensitive. Confirm that new pods have time to become ready before scale-in removes capacity again.

A scheduled shutdown interrupts a needed environment

Move the workload to an exception list with a named owner and expiry date. Review schedules when release calendars, training runs, or customer demonstrations change; a static calendar is not a substitute for ownership.

Cost appears lower but reliability is worse

Compare the change with latency, availability, cold starts, pending-pod time, and interruption rate. Restore a minimum capacity or relax scale-down if an SLO has regressed. Treat the policy as successful only when the financial and service measurements improve together.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

A decision framework for each workload

Before selecting a control, answer these questions in order:

  1. Is demand steady, bursty, periodic, or unpredictable?
  2. Can users tolerate a cold start while a model loads?
  3. Does the workload require a particular GPU memory size or accelerator type?
  4. Can it scale to zero, or must a warm replica remain?
  5. Can nodes be consolidated and pods interrupted safely?
  6. Can spend be allocated to an owner and measured per request or job?
  7. Is the baseline stable enough for a reservation or savings plan, or should capacity remain elastic?

The answers determine the combination, not a single product choice. A production endpoint may use a committed minimum plus HPA and node autoscaling. A test cluster may use a calendar shutdown. A sporadic queue consumer may use KEDA scale-to-zero. A flexible batch job may use delayed scheduling and interruptible capacity. In each case, the control should reflect the workload’s demand and service promise.
